100 — Asynchronous Fine-Tuning Pipelines

Run data preparation, adaptation, evaluation, and model promotion as a durable offline workflow with explicit quality gates and lineage.

Concept overview

Asynchronous fine-tuning pipelines separate training work from user-facing inference. Feedback and approved examples enter a durable preparation process; training jobs run independently; candidate artifacts are evaluated before any serving change. A user interaction can contribute a reviewable example without immediately modifying the deployed model.

The pipeline’s key invariant is controlled promotion. New weights or adapters should never become production simply because a training job completed. Dataset provenance, privacy handling, leakage prevention, baseline comparisons, and serving compatibility are part of the artifact’s lineage. Automatic scheduling is compatible with strict gates; unrestricted self-training from raw conversations is not required.

Why it matters in production

Proof of concept

A prototype runs a small reproducible dataset through training and held-out evaluation without touching the live endpoint.

Production

Production adds durable job state, dataset approval, retryable stages, artifact registration, and canary promotion.

Enterprise scale

Enterprise scale manages compute quotas, multiple candidate branches, deletion and retention requirements, and reproducible rollback across data, model, adapter, and runtime versions.

Architecture components

Feedback intake

Collects approved corrections and outcomes with consent, provenance, and review status.

Dataset builder

Cleans examples, removes prohibited data, deduplicates, and creates leakage-resistant splits.

Training orchestrator

Schedules durable jobs and records checkpoints, resources, and configuration.

Evaluation gate

Compares candidates with the deployed baseline on task, safety, and regression suites.

Artifact registry and release controller

Stores complete lineage and promotes only approved serving bundles.

The architecture, mapped

Offline learning with controlled promotion — Training completion creates a candidate; evaluation and release gates determine whether it becomes a serving version.

Runtime flow

  1. 1

    Collect reviewable examples

Ingest feedback as candidates with source and permission metadata rather than immediate training truth.

  2. 2

    Build a frozen dataset

Apply quality review, redaction, deduplication, and stable train-validation-test partitions.

  3. 3

    Schedule training

Submit an idempotent job under resource limits and record the full configuration.

  4. 4

    Register the candidate

Store weights or adapters with base-model, data, code, and runtime lineage.

  5. 5

    Evaluate and gate

Require held-out improvements and acceptable critical-slice behavior before release eligibility.

  6. 6

    Canary and observe

Promote a small traffic cohort, compare live outcomes, and roll back the complete bundle if needed.

Learning from reviewed resolution corrections

Technical support · Illustrative enterprise scenario, not a reported customer outcome.

Business situation

A support organization reviews assistant drafts and records corrected troubleshooting summaries.

The problem

Useful corrections accumulate, but manually retraining and deploying models is slow and inconsistent.

Agent requirement

Turn approved corrections into reproducible candidate adaptations without feeding raw customer conversations directly into production learning.

Architecture

A governed dataset builder creates periodic snapshots, and asynchronous adapter jobs feed a registry and evaluation gate.

Runtime

  • Reviewed corrections enter a versioned dataset after privacy and quality checks.
  • A candidate is evaluated on unseen product issues and canaried only if critical troubleshooting behavior remains acceptable.

Failure scenario

If a training job retries after a worker failure, the job identity prevents duplicate promotion; if evaluation regresses, the deployed model remains unchanged.

Operational impact

Measure dataset acceptance, reproducibility, held-out quality, training cost, and post-release correction rate; job completion throughput alone says little about useful model improvement.

Architecture tradeoffs

DecisionBenefitCost
Asynchronous trainingDecouples compute-heavy adaptation from user latency.Adds job-state and artifact orchestration.
Frequent small updatesRespond to reviewed behavior gaps sooner.Increase evaluation and release overhead.
Strict promotion gatesProtect deployed quality and traceability. Can delay release when evidence is incomplete.

Failure scenarios & recovery

Raw feedback contaminates training

Detect: Unreviewed or sensitive examples appear in the dataset manifest.

Recover: Quarantine affected data and rebuild from approved sources.

Candidate passes leaked evaluation

Detect: Training and test share source-derived examples.

Recover: Repartition by lineage or time and rerun independent evaluation.

Common architecture mistakes

Deploying automatically on training success

Require explicit quality and serving gates.

Losing dataset lineage

Store immutable manifests and transformation versions.

Ignoring compatibility at promotion

Evaluate the exact base, adapter, tokenizer, and runtime bundle.

When to choose this pattern

Choose it when

  • Use for recurring adaptation from reviewed examples.
  • Use when training must not block serving.
  • Use when reproducibility and rollback are operational requirements.

Avoid it when

  • Avoid raw-conversation self-training without governance.
  • Do not fine-tune merely to refresh changing facts.
  • Avoid automated promotion without meaningful held-out evaluation.

Architecture checklist

  • Review and authorize training examples.
  • Freeze dataset manifests and splits.
  • Make jobs idempotent and resumable.
  • Record complete artifact lineage.
  • Gate on critical-slice regressions.
  • Canary and retain a tested rollback bundle.
